Claiming Back Credit Card Overlimit Fees - Possible?

The credit card is with Capital One and not my bank.
First of all before I explain the problem, I know this was my own fault but could really do with getting the money back or just some of it, which I would then use the full amount to pay off towards my current balance.
The problem is...I admit to you all I have NOT been checking my statements for this particular card. I have been concentrating on paying off my other cards which have a higher interest rate and recently did clear one, then I was looking into this one properly and I realised for a LONG time I have been getting charged overlimit fees each month, they used to be £20 then recently changed to £12, but I have had a direct debit setup since I got the card and it always was taken out of my account and I did not get a single letter explaining to me that I am over my credit limit and that I had been charged for this! Should they have sent me a letter and can I claim back these charges like it is possible with Bank charges or is just my own tough look, my own fault, and I have nobody else to blame but myself for being so stupid.
I'm really annoyed at myself for letting this happen and I know some people are just going to think I am an idiot but I just need some advice on if i can get any of this money back and get on top of things? I have already sent a payment today to cover what I am over (due to the fee) and I am increasing my payments now since I paid off my other card which is now a closed account.

EDIT: I am NOT currently spending on this card atall and haven't for a long time. Just trying to get out of this long tunnel of debt and this is a big blow to my efforts
